Indeed

Marketing Personalization

Indeed wanted job recommendations to explain why a role fits a candidate instead of only matching on structured attributes, but needed to do it efficiently at massive messaging scale.

13% uplift in downstream success
20% increase in started job applications
60% fewer tokens after fine-tuning a smaller model
More than 3.5 million employers and over 32 million jobs

Reported impact

Business outcome

Indeed scaled personalized match explanations from 1 million to nearly 20 million messages a day, increased started applications by 20%, improved downstream fit by 13%, and made the GPT-powered recommendation layer ROI-positive during testing.

Solution

Indeed combined its long-standing job-matching AI with OpenAI GPT models to improve the language and context behind Invite to Apply recommendations. The team first used the Chat Completions API and few-shot prompting to generate richer explanations for why a candidate matched a specific job, then realized the prompt-heavy approach consumed too many tokens at Indeed's scale. In response, Indeed and OpenAI fine-tuned a smaller GPT model using GPT-4 for data augmentation, an annotation operation with labeled outputs and ground truths, and content guidelines that taught the model to explain relevance economically. Dedicated instances let the engineering team deploy the fine-tuned model at very high volume, personalizing recommendations to millions more job seekers. The result is a recommendation system that still depends on Indeed's proprietary marketplace data and matching logic, but now adds a natural-language rationale that improves both application starts and downstream hiring success.

Data flow

Indeed combines resume, profile, and qualification data with job-posting context, then passes the matched candidate-job pair to the fine-tuned GPT model for a natural-language explanation. The generated rationale is sent through Invite to Apply at scale on dedicated instances and measured through A/B tests against downstream hiring outcomes.

    • OpenAI GPT models Generate personalized explanations that tell job seekers why a recommendation fits their background.
    • fine-tuned GPT model Delivers similar personalization quality with far lower token use at Indeed's production scale.
    • GPT-4 Supports data augmentation and helps create training material for the fine-tuning process.
  2. Serving
    • dedicated instances Provide the scalable serving environment for personalized recommendation messaging to millions of job seekers.

Architecture clues

  • Annotation operations created ground truths for automated evaluation
  • Dedicated instances were provisioned for high-volume personalization
  • Few-shot prompting was replaced by a fine-tuned smaller GPT model for efficiency
  • GPT-4 was used for data augmentation during training

How scores are calculated

Customer Reference Value measures usefulness as a customer reference. Evidence Confidence measures the quality and traceability of available evidence, not independent verification.

Customer reference value100/100
  • Problem clarity20/20
Measures whether the customer's operational problem is specific enough to compare.
  • Implementation depth25/25
Rewards named components, data flow, integrations, and architecture detail.
  • Outcome specificity20/20
Measures whether the reported benefit is concrete rather than a generic claim.
  • Quantified impact25/25
    4 metrics describe measurable impact.
  • Deployment scale10/10
Rewards evidence of a live or scaled deployment and meaningful integration scope.
Evidence confidence90%
  • Source authority20/25
The main evidence is an official vendor-published customer story.
  • Claim traceability23/25
11 of 12 key fields link to a named source.
